This paper investigates why large language models (LLMs) are effective in solving real-world decision-making problems. The researchers propose a hierarchical reinforcement learning (RL) framework that combines high-level task planning with low-level execution. They show that LLMs can learn to navigate partially observable Markov decision processes (POMDPs) by generating language-based subgoals and demonstrate the importance of exploration beyond these subgoals. To address this, they introduce an epsilon-greedy exploration strategy that incurs sublinear regret when the pretraining error is small. The framework is extended to include scenarios where the LLM serves as a world model for inferring environmental transitions and multi-agent settings for coordinating multiple actors.
