Medium Difficulty summary: This paper presents a novel approach called Compression Memory Training (CMT) to efficiently adapt Large Language Models (LLMs) to changing data, tasks, and user preferences without retraining the massive models. CMT compresses and extracts information from new documents, storing it in a memory bank that helps the model answer queries related to these documents. The method reduces the risk of catastrophic forgetting by not modifying the LLM’s parameters during training and inference. To enhance encoding, retrieval, and aggregation of memory, three new techniques are proposed: memory-aware objective, self-matching, and top-aggregation. Experimental results on three continual learning datasets (StreamingQA, SQuAD, and ArchivalQA) demonstrate improved model adaptability and robustness across multiple base LLMs.
