The proposed Deep Diffusion Policy Gradient (DDiffPG) algorithm is a novel actor-critic method that learns to parameterize policies as diffusion models in reinforcement learning. Unlike traditional RL methods, DDiffPG can discover and maintain versatile behaviors across multiple modes by combining off-the-shelf unsupervised clustering with novelty-based intrinsic motivation. The algorithm forms a multimodal training batch and utilizes mode-specific Q-learning to mitigate the greedy objective of RL methods. This allows the policy to be conditioned on mode-specific embeddings for explicit control over learned modes. Experimental results demonstrate DDiffPG’s ability to master complex continuous control tasks with sparse rewards, as well as proof-of-concept dynamic online replanning in navigation tasks.
